摘要
本文提出了一种新型视觉Transformer架构——Swin Transformer,旨在构建适用于计算机视觉领域的通用骨干网络。将Transformer从自然语言处理领域迁移至视觉领域面临的核心挑战源于两个领域间的本质差异,包括视觉实体尺度变化显著以及图像像素分辨率远高于文本词汇量级。为解决这些差异,我们设计了一种分层Transformer架构,其表征通过移位窗口计算机制实现。移位窗口方案将自注意力计算约束于非重叠的局部窗口内,同时保持跨窗口连接能力,从而显著提升计算效率。该分层架构具备多尺度建模的灵活性,且计算复杂度与输入图像尺寸呈线性关系。Swin Transformer的架构特性使其能够兼容广泛的视觉任务,包括图像分类(在ImageNet-1K数据集上达到87.3%的top-1准确率)以及密集预测任务,如目标检测(在COCO test-dev数据集上实现58.7%的框准确率和51.1%的掩码准确率)和语义分割(在ADE20K val数据集上获得53.5%的mIoU)。实验结果表明,该模型性能显著超越先前最佳水平,在COCO数据集上框准确率和掩码准确率分别提升2.7和2.6个百分点,在ADE20K数据集上mIoU提升3.2个百分点,充分证明了Transformer架构作为视觉骨干网络的巨大潜力。此外,所提出的分层设计和移位窗口方法也被证实对所有MLP架构具有普适性增益。

基本原理
Swin Transformer(Liu et al., 2021)是一种基于 Transformer 的深度学习模型,在视觉任务中具有最先进的性能。与之前的 Vision Transformer (ViT) (Dosovitskiy et al., 2020) 不同,Swin Transformer 效率高且精度更高。由于这些理想的特性,Swin Transformers 被用作当今许多基于视觉的模型架构的骨干。
Swin Transformer引入了两个关键概念来解决原始ViT(视觉变换器)所面临的问题——层次化特征图和移位窗口注意力机制。实际上,Swin Transformer的名称来源于“移位窗口变换器”。Swin Transformer的整体架构如下所示。
请注意,在论文中,第一个块使用了“块划分”(patch partition)。为了简化,这个图中将第一个块标为“块合并”(patch merging),因为它们的操作是相似的。
如我们所见,“块合并”(Patch Merging)模块和“Swin Transformer模块”是Swin Transformer中的两个关键构建块。
Hierarchical Feature Maps
Swin Transformer与ViT(视觉变换器)的首个显著不同之处在于它构建了“层次化特征图”。让我们将这个概念分解成两部分,以更好地理解它的含义。
首先,“特征图”简单来说就是每个连续层生成的中间张量。至于“层次化”,在这个上下文中,它指的是特征图从一层到另一层的合并(下一节会有更多细节),有效地减少了特征图的空间维度(即下采样)。

Patch Merging
在上一节中,我们看到了如何通过逐步合并和下采样特征图的空间分辨率来构建层次化特征图。在像ResNet这样的卷积神经网络中,特征图的下采样是通过卷积操作完成的。那么,我们如何在不使用卷积的纯变换器网络中对特征图进行下采样呢?
Swin Transformer中使用的无卷积下采样技术被称为“块合并”(Patch Merging)。在这个上下文中,“块”指的是特征图中的最小单元。换句话说,在一个14x14的特征图中,有14x14=196个块。
为了将特征图下采样n倍,块合并将每组n x n相邻块的特征进行拼接。我知道这可能难以理解,下面这个动画可以更好地说明这一点。块合并操作通过将n x n块分组并深度方向上拼接这些块,将输入下采样n倍。

Swin Transformer Block
Swin Transformer中使用的变换器模块用窗口多头自注意力(W-MSA)和移位窗口多头自注意力(SW-MSA)模块取代了ViT中使用的标准多头自注意力(MSA)模块。下面展示了Swin Transformer块的结构。
Swin Transformer块包含两个子单元。每个子单元由一个归一化层开始,接着是一个注意力模块,然后是另一个归一化层和一个多层感知机(MLP)层。第一个子单元使用窗口多头自注意力(W-MSA)模块,而第二个子单元使用移位窗口多头自注意力(SW-MSA)模块。
基于窗口的自注意力
ViT中使用的标准MSA执行全局自注意力,并且每个块与所有其他块之间的关系都会被计算。这导致了与块数量成二次方复杂度的计算,使其不适用于高分辨率图像。
为了解决这个问题,Swin Transformer采用了基于窗口的MSA方法。一个窗口简单来说就是一组块的集合,并且注意力只在每个窗口内计算。例如,下面的插图使用了2 x 2块的窗口大小,基于窗口的MSA只在每个窗口内计算注意力。
由于整个网络中窗口大小是固定的,基于窗口的MSA的复杂度与块的数量(即图像的大小)成线性关系,这比标准MSA的二次方复杂度有了很大的改进。
移位窗口自注意力
然而,基于窗口的MSA的一个明显缺点是,将自注意力限制在每个窗口内限制了网络的建模能力。为了解决这个问题,在W-MSA模块之后,Swin Transformer使用了移位窗口多头自注意力(SW-MSA)模块。
为了引入跨窗口连接,移位窗口MSA将窗口向右下角移动M/2个单位,其中M是窗口大小(上面动画中的第1步)。
然而,这种移动导致了一些“孤立”块不属于任何窗口,以及一些窗口中块不完整。Swin Transformer采用了“循环移位”技术(上面动画中的第2步),将“孤立”块移动到块不完整的窗口中。注意,在这次移位之后,一个窗口可能包含在原始特征图中不相邻的块,因此在计算过程中应用了掩码来限制自注意力仅在相邻块之间。
